Same Trajectory, Contradictory Rewards (ROBORMBENCH): Paraphrase Fragility in Vision Language Reward Models

Vision-language models are increasingly used as reward functions for robotic learning, but this role requires paraphrase invariance: the same trajectory should receive the same reward under semantically equivalent goal descriptions. We show that current VLM reward models often violate this property. Paraphrasing the instruction alone can substantially change predicted progress scores, and can even flip identical robot behavior between failure and success. To measure this failure mode, we introduce ROBORMBENCH, a benchmark with 2,390 real-robot trajectories, ground-truth progress labels, and 21,673 verified paraphrases spanning lexical, syntactic, and action-goal rewrites. Across proprietary and open-source VLMs, paraphrase-induced instability is widespread and severe, grows under more divergent rewrites, and is not reliably reduced by scale or explicit reasoning. Dedicated reward models trained with trajectory-grounded supervision are substantially more stable. These results show that paraphrase robustness is a core requirement for reliable VLM-based reward modeling in robotics.

Differential Privacy in Feature Reconstruction Aided Federated Learning for Agent's Semantic Communication Model Update

This paper proposes a differentially private federated learning (FL) framework built upon an FL algorithm with semantic feature reconstruction (FedSFR) for training semantic communication modules for image transmission. By allowing clients with unfavorable uplink capacity to transmit low-dimensional semantic feature vectors extracted from locally trained joint source-channel coding (JSCC) encoders, FedSFR enhances communication efficiency and training stability under heterogeneous wireless conditions. To protect client privacy, we incorporate the oneshot Laplace mechanism and theoretically demonstrate that feature-based transmission achieves strictly stronger differential privacy (DP) guarantees than gradient-based transmission under an identical communication budget. In addition, a model selection mechanism is introduced to alleviate performance degradation caused by privacy-preserving perturbations. Experimental results on multiple datasets show that the proposed DP-aided FedSFR outperforms DP-enabled FedAvg in training stability and image reconstruction quality in heterogeneous wireless systems.

Memorization In Stable Diffusion Is Unexpectedly Driven by CLIP Embeddings

Understanding how textual embeddings contribute to memorization in text-to-image diffusion models is crucial for both interpretability and safety. This paper investigates an unexpected behavior of CLIP embeddings in Stable Diffusion, revealing that the model disproportionately relies on specific embeddings. We categorize input tokens as , , and with corresponding embeddings $\mathbf{v}^{\mathbf{sot}}, \mathbf{v}^{\mathbf{pr}}, \mathbf{v}^{\mathbf{eot}}, \mathbf{v}^{\mathbf{pad}}$. We discover that $\mathbf{v}^{\mathbf{pr}}$ contribute minimally to generation in memorized cases. In contrast, $\mathbf{v}^{\mathbf{pad}}$ strongly affect memorization due to their structural duplication of $\mathbf{v}^{\mathbf{eot}}$, the only embedding explicitly optimized during CLIP training. This duplication unintentionally amplifies the influence of $\mathbf{v}^{\mathbf{eot}}$, causing the model to over-rely on it, thereby driving memorization. Based on these observations, we propose two simple yet effective inference-time mitigation strategies: (1) Replacing the tokenizer's default from to the ! token before embedding, and masking the $\mathbf{v}^{\mathbf{eot}}$; (2) Partial masking of $\mathbf{v}^{\mathbf{pad}}$. Both suppress memorization without degrading quality, and are readily deployable without prior detection.

DAPD: Dependency-Aware Parallel Decoding via Attention for Diffusion LLMs

Parallel decoding for Diffusion LLMs (dLLMs) is difficult because each denoising step provides only token-wise marginal distributions, while unmasking multiple tokens simultaneously requires accounting for inter-token dependencies. We propose Dependency-Aware Parallel Decoding (DAPD), a simple, training-free decoding method that uses self-attention to induce a conditional dependency graph over masked tokens. At each iteration, edges in this graph capture strong token interactions, while non-edges indicate weak dependence. Parallel decoding is then reduced to selecting an independent set on the graph and unmasking the selected tokens in parallel. This avoids co-updating strongly coupled tokens without auxiliary models or retraining. Experiments on LLaDA and Dream show that DAPD improves the accuracy-steps trade-off over existing methods and enables more globally distributed parallel updates that better exploit the any-order generation capability of dLLMs. The project is available at https://ai-isl.github.io/dapd

Rainbow Padding: Mitigating Early Termination in Instruction-Tuned Diffusion LLMs

Diffusion large language models (dLLMs) have emerged as a promising alternative to autoregressive models, offering flexible generation orders and strong performance on complex reasoning tasks. However, instruction-tuned dLLMs exhibit a critical vulnerability we term \texttt{ } overflow: as allocated sequence length increases, responses paradoxically become shorter, collapsing into early termination or degenerating into streams of \texttt{ } tokens. Although noticed in practice, this issue has not been systematically analyzed. We trace its root cause to the dual role of \texttt{ } as both termination and padding, which concentrates probability mass on \texttt{ } at later positions and propagates backward to trigger early termination. To address this, we introduce Rainbow Padding, a simple remedy that replaces repeated \texttt{ } placeholders with a repeating cycle of distinct padding tokens, distributing probability mass and breaking \texttt{ } dominance. Experiments show that Rainbow Padding substantially improves length robustness and output quality, with as few as seven padding tokens sufficient to prevent early termination. Moreover, the method integrates efficiently into existing instruction-tuned models: LoRA fine-tuning for a single epoch on minimal data yields significant improvements, making this solution highly practical. Federated Learning Enhanced by Feature Reconstruction for Semantic Communication Module Updates of Agents

Recent advancements in semantic communication have primarily focused on image transmission, where neural network-based joint source-channel coding modules play a central role. However, such systems often experience semantic communication errors due to mismatched knowledge bases between agents and performance degradation from outdated models, necessitating regular model updates. To address these challenges in vector quantization (VQ)-based image semantic communication systems, we propose FedSFR, a novel federated learning framework that incorporates semantic feature reconstruction (FR). FedSFR introduces an FR step at the parameter server and allows a subset of clients to transmit compact feature vectors in lieu of sending full local model updates, thereby improving training stability and communication efficiency. To enable effective FR learning, we design a loss function tailored for VQ-based image semantic communication and demonstrate its validity as a surrogate for image reconstruction error. We further establish a rigorous convergence analysis of FedSFR. Experimental results on two benchmark datasets validate the superiority of FedSFR over existing baselines, especially in capacity-constrained settings, confirming both its effectiveness and robustness.

Feature Reconstruction Aided Federated Learning for Image Semantic Communication

Research in semantic communication has garnered considerable attention, particularly in the area of image transmission, where joint source-channel coding (JSCC)-based neural network (NN) modules are frequently employed. However, these systems often experience performance degradation over time due to an outdated knowledge base, highlighting the need for periodic updates. To address this challenge in the context of training JSCC modules for image transmission, we propose a federated learning (FL) algorithm with semantic feature reconstruction (FR), named FedSFR. This algorithm more efficiently utilizes the available communication capacity by allowing some of the selected FL participants to transmit smaller feature vectors instead of local update information. Unlike conventional FL methods, our approach integrates FR at the parameter server (PS), stabilizing training and enhancing image transmission quality. Experimental results demonstrate that the proposed scheme significantly enhances both the stability and effectiveness of the FL process compared to other algorithms. Furthermore, we mathematically derive the convergence rate to validate the improved performance.

Two Stage Wireless Federated LoRA Fine-Tuning with Sparsified Orthogonal Updates

Federated fine-tuning with low-rank adaptation (LoRA) communicates only two low-rank matrices instead of the full model, but existing methods typically fix the LoRA rank in advance as a manually tuned hyperparameter. In wireless networks, however, the rank determines both adaptation capacity and uplink payload, while the deliverable payload varies with the fading channel. To address this coupling, we formulate wireless federated LoRA fine-tuning as a two-timescale design that separates the \emph{offline-optimized rank}, i.e., the rank of the shared LoRA structure selected before training from statistical channel information, from the per-iteration sparsification and bandwidth decisions adapted to instantaneous CSI. For per-iteration adaptation, we propose sparsified orthogonal fine-tuning (\textbf{SOFT}), which promotes near-orthogonality among rank components so that the product of the corresponding column and row norms approximates each component's singular value. This SVD-free score guides component-wise payload allocation and within-component entry selection without forming the full matrix product. We further derive a convergence bound linking the two timescales and develop a two-stage federated algorithm (\textbf{TSFA}) that selects the offline-optimized rank offline and jointly optimizes sparsification and bandwidth online via Lyapunov optimization.

Privacy-Enhanced Over-the-Air Federated Learning via Client-Driven Power Balancing

This paper introduces a novel privacy-enhanced over-the-air Federated Learning (OTA-FL) framework using client-driven power balancing (CDPB) to address privacy concerns in OTA-FL systems. In recent studies, a server determines the power balancing based on the continuous transmission of channel state information (CSI) from each client. Furthermore, they concentrate on fulfilling privacy requirements in every global iteration, which can heighten the risk of privacy exposure as the learning process extends. To mitigate these risks, we propose two CDPB strategies -- CDPB-n (noisy) and CDPB-i (idle) -- allowing clients to adjust transmission power independently, without sharing CSI. CDPB-n transmits noise during poor conditions, while CDPB-i pauses transmission until conditions improve. To further enhance privacy and learning efficiency, we show a mixed strategy, CDPB-mixed, which combines CDPB-n and CDPB-i. Our experimental results show that CDPB outperforms traditional approaches in terms of model accuracy and privacy guarantees, providing a practical solution for enhancing OTA-FL in resource-constrained environments.

Small Language Models are Equation Reasoners

Chain-of-Thought (CoT) reasoning has enabled Large Language Model (LLM) to achieve remarkable performance in various NLP tasks, including arithmetic problem-solving. However, this success does not generalize to small language model (sLM) like T5, due to their limited capacity and absence of emergent abilities associated with larger models. Recent works to enhance sLM through knowledge distillation have yielded some improvements but still face significant limitations, particularly high ambiguity from the variability in natural language expressions and substantial computational costs. In this paper, we investigate why sLM perform poorly on arithmetic reasoning tasks and hypothesize that natural language format variability introduces high ambiguity for these smaller models. Based on this hypothesis, we conduct experiments with equation-only format, which is a reasoning format that unifies arithmetic reasoning previously expressed in natural language formats into mathematical equations. Experiment results demonstrate that equation-only format effectively boosts the arithmetic reasoning abilities of sLM, especially in very small models like T5-Tiny.
